  • Adversarial debiasing: Train a model to predict outcomes while an adversary tries to predict the sensitive attribute from the model’s representations — minimize that adversary’s success.

Trade-offs: Powerful but fiddly. You get explicit trade-offs between accuracy and fairness — which you’ll need to document for governance.

  1. Diagnose first (you did this already — sources of bias): Is it sampling bias? Labeling noise? Proxy features? Model architecture? Answer this before you act.
  2. Define the fairness goal (e.g., equal opportunity vs. calibration). This matters — different goals can conflict.
  3. Pick the least-invasive effective method: Start with pre-processing if data is fixable, in-processing if you control training, post-processing for black-box fixes.
  4. Simulate trade-offs: Run A/B tests with fairness metrics and utility impacts. Plot performance vs. fairness.
  5. Govern & document: Log choices, metrics, and stakeholder sign-off.
  6. Monitor in production: Bias can creep back — set alerts for drift and metric degradation.

Problem: Loan approvals are lower for applicants from a certain zip code correlated with a protected attribute.
